TL;DR

Rapidly expanding literature makes comprehensive and current survey writing difficult because context limits, incomplete model knowledge, and costly quality assurance constrain direct LLM use. AutoSurvey2 combines retrieval-guided planning, modular generation, real-time retrieval, and multi-LLM evaluation; it consistently outperforms automated baselines in coverage, structural coherence, and relevance while maintaining citation grounding. The framework offers a scalable, reproducible approach to long-form survey generation, although its quality depends on database completeness and still requires refinement and human verification.

Abstract

from arXiv · show

The rapid growth of research literature, particularly in large language models (LLMs), has made producing comprehensive and current survey papers increasingly difficult. This paper introduces autosurvey2, a multi-stage pipeline that automates survey generation through retrieval-augmented synthesis and structured evaluation. The system integrates parallel section generation, iterative refinement, and real-time retrieval of recent publications to ensure both topical completeness and factual accuracy. Quality is assessed using a multi-LLM evaluation framework that measures coverage, structure, and relevance in alignment with expert review standards. Experimental results demonstrate that autosurvey2 consistently outperforms existing retrieval-based and automated baselines, achieving higher scores in structural coherence and topical relevance while maintaining strong citation fidelity. By combining retrieval, reasoning, and automated evaluation into a unified framework, autosurvey2 provides a scalable and reproducible solution for generating long-form academic surveys and contributes a solid foundation for future research on automated scholarly writing. 3 Methodology

AutoSurvey2 is a modular survey-generation pipeline that uses indexed literature retrieval, graph-based stage coordination, LLM synthesis, and automated post-processing to produce reproducible, publication-ready documents.

3.1 Overview

  • A graph-based state machine coordinates Database Construction, Research Planning, Research Phase, Generation Phase, and Post-processing through shared state Σ.Specialized nodes communicate through shared intermediate data, supporting consistency, traceability, modular development, and reproducible execution.Source: Figure 1 · p. 4, §3.1 · p. 4

3.2 Database Construction

  • A domain-specific repository filters ArXiv metadata to AI and machine-learning categories, encodes abstracts into 768-dimensional vectors, and supports semantic search through PostgreSQL with pgvector.Incremental ingestion embeds only new papers, and the resulting repository contains hundreds of thousands of papers for sub-second retrieval.Source: §3.2 · p. 5

3.3 Stage 1: Research Planning

  • Research Planning retrieves a reference corpus, uses an LLM to identify themes and challenges, and constructs an eight-section outline stored in shared state Σ.The default reference corpus contains 1,500 papers, and the output is constrained to exactly eight numbered sections.Source: §3.3 · pp. 5–6

3.4 Stage 2: Research Phase

  • For each outline section, the Research Phase retrieves 20 papers, analyzes the top five, and synthesizes grounded academic prose with IEEE-style citations. The analysis extracts contributions, methodologies, contrasts, technical nuances, and limitations before generation combines the analysis with retrieved papers and structural constraints.Source: §3.4 · pp. 6–7

3.5 Stage 3: Generation Phase

  • The Generation Phase creates the abstract and conclusion from generated sections, formats the manuscript as IEEE-compliant LATEX, and serializes the complete state for reproducibility. The abstract is constrained to 250–300 words, while the conclusion is constrained to 400–500 words.Source: §3.5 · pp. 7–8

3.6 Stage 4: Post-processing

  • Post-processing extracts citations, generates BibTeX, improves formatting, conditionally replaces preprint entries with DBLP publications, and assembles a compilable final survey. The resulting PDF is described as fully formatted with verified references and publication-ready IEEE styling.Source: §3.6 · pp. 8–9

4 Prompt Design

AutoSurvey2 uses structured prompts throughout its pipeline to guide outline construction, literature analysis, academic synthesis, and meta-section generation while enforcing grounding and formatting constraints.

  • Progressive prompts guide outline generation, section analysis, and prose synthesis using retrieved literature, structured outputs, formal style, and IEEE-style citations. The prompts respectively identify section themes, summarize contributions and challenges, and convert analyses into coherent academic text.Source: §4 · p. 9
  • Meta-section prompts generate a 250–300-word abstract and a 400–500-word conclusion, while shared prompt principles support role alignment, coverage, grounding, deterministic parsing, and coherence. These principles are intended to maintain scholarly rigor, stylistic consistency, and factual reliability across the generated survey.Source: §4 · p. 9

5 Experiments

The experiments evaluate AutoSurvey2 with a reproducible multi-topic setup that measures survey coverage, structure, and relevance against baseline systems using an automated Judge Agent.

  • The experimental setup is designed to assess both the effectiveness and completeness of long-form survey generation through reproducible and transparent procedures. The infrastructure includes PostgreSQL for paper metadata and retrieval results, with vector operations supported by the specified embedding model.Source: §5 · p. 9
  • Each survey can consider up to 1,500 reference papers, generate eight sections, and retrieve 20 candidate papers per section.Vector search uses a top-k of 100 with a similarity threshold of 0.7, while GPT-4.1 performs generation and refinement tasks.Source: §5 · pp. 9–10
  • Coverage, Structure, and Relevance are scored on 1–5 Likert scales by a deterministic Judge Agent using explicit rubrics and structured output parsing.Coverage measures topic comprehensiveness, Structure measures organization and coherence, and Relevance measures topical alignment and citation accuracy.Source: §5 · p. 10
  • Experiments use ten topics spanning computer science, mathematics, and physics, with scores averaged across assessors and topics for baseline comparisons.Generated surveys are evaluated individually and comparatively for coverage, structural quality, and citation relevance.Source: §5 · p. 10

6 Results

AutoSurvey2 outperforms AutoSurvey and Naive RAG across coverage, structure, and relevance, while ablations show planning and refactoring are important for coherent survey generation.

  • 4.76 average score made AutoSurvey2 the top system across Coverage, Structure, and Relevance, outperforming AutoSurvey and Naive RAG in every category.Table 1 attributes these gains to graph-based planning and semantic retrieval.Source: §6 · p. 10, Table 1 · p. 10
  • Removing planning reduced Structure from 4.68 to 3.78, indicating that global topic decomposition supports logical continuity across sections.Source: §6 · p. 10, Table 2 · p. 11
  • Removing refactoring decreased Structure and Relevance because iterative refinement supported inter-section alignment and stylistic uniformity.Source: §6 · p. 10
  • Despite degradation, both ablated variants still outperformed earlier baselines, indicating robustness in the underlying retrieval and synthesis mechanisms.Source: §6 · p. 10

7 Conclusion

AutoSurvey2 combines structured planning, retrieval augmentation, and iterative refinement to generate long-form academic surveys. It outperforms prior baselines in coverage, structural coherence, and relevance while supporting scalable academic writing.

  • AutoSurvey2 consistently outperforms prior baselines in coverage, structural coherence, and relevance, approaching human-authored survey quality.Source: §7 · p. 11

8 Limitations

AutoSurvey2 remains constrained by literature-database quality, occasional stylistic inconsistency from parallel generation, and limitations inherited from its LLM components.

  • Output quality depends on the literature database’s completeness and accuracy, since missing or misclassified entries can cause important works to be overlooked.Source: §8 · p. 11
